Strong Reasoning at Constant Memory

Rock Matrix

Technical Report   ·   arXiv:2610.10118   ·   GitHub   ·   Hugging Face   ·   ModelScope

EdgeRock is a family of multimodal models that deliver strong reasoning at constant memory. EdgeRock-4B is the first open-source release, with text and image reasoning; additional model sizes are in preparation.

Long reasoning grows the KV cache, consumes accelerator memory, and limits serving concurrency. On edge devices, reasoning must also share memory with perception and control. EdgeRock fixes the history budget: recurrent state summarizes context, local attention covers recent tokens, and Rock Memory Anchors (RMA) keep selected distant details directly retrievable.

  • Strong reasoning at constant history: EdgeRock-4B reaches 82.9% mean pass@1 on AIME 2024–2026, versus 18.8% for the strongest evaluated bounded-state baseline, RWKV-7 G1j in the 14B class. Capability results.
  • Fixed-capacity KV storage: EdgeRock-4B uses 72 MiB of attention KV per sequence and 121.76 MiB of total persistent history with FP32 recurrence and auxiliary state. At 256K context, its BF16 attention KV is 99.1% smaller than Qwen3.5-4B's. Memory breakdown.
  • Sustained inference: On one Hopper 80GB GPU, EdgeRock-4B sustains 233.7 decode tokens/s at batch size 1 with 128K input and 128K output. At 32K input and 32K output, it delivers 5.65× Qwen3.5-4B's end-to-end output-token throughput, using each model's best measured batch size. Runtime results.
  • Text and image reasoning: EdgeRock-4B reaches 84.9% mean answer-level accuracy across six visual benchmarks, retaining 95.3% of Qwen3.5-4B's mean accuracy. Visual results.

EdgeRock-4B: AIME reasoning, constant attention-KV storage, and Hopper 80GB inference throughput

Throughput counts output tokens only; end-to-end elapsed time includes prefill. Runtime comparisons use BF16 weights/KV and ordinary autoregressive decoding, with FP32 recurrence for EdgeRock-4B and Qwen3.5-4B. The full tables below separate bounded-state models, source-model retention, and compact-model comparisons.

The portable backend provides PyTorch execution on CPU and CUDA. The optimized Hopper CUDA path requires the additional dependencies in the inference guide. The fast profile preserves BF16 weights/KV and FP32 recurrent state; it changes execution, not precision.

How Rock Memory Anchors work

A memory anchor is a learned key–value record stored in a fixed-capacity bank and retrieved by later queries after its source information leaves the local attention window. The writer determines what a record represents, admission determines which records remain, and retrieval determines how stored information contributes to the current computation.

EdgeRock-4B architecture: recurrent state, sliding-window attention, and Rock Memory Anchors

EdgeRock-4B converts the eight full-attention layers of its Qwen3.5-4B backbone while retaining 24 Gated DeltaNet layers and the feed-forward blocks:

[GDN, GDN, GDN, sliding-window attention ∥ RMA] × 8
History component Role Capacity
Recurrent state Summarize the evolving context Fixed-dimensional matrices
Local attention Resolve recent token interactions 1,024 positions
RMA anchor bank Retain individually retrievable distant records 1,024 records per KV group
Pending candidates Collect records for the next admission update 256 positions

A learned writer produces dedicated key–value records. Every 256 tokens, admission retains the highest-priority records separately in each of four KV groups. Queries read the committed bank; newly selected records become visible in the next block. Retained records remain separate and unchanged. A query-dependent read and signed gate integrate retrieved information alongside local attention.

Every component of persistent history has fixed capacity. History storage is O(1) in sequence length, and bounded history access gives O(N) generation work for N output tokens at fixed model and memory dimensions. Total GPU memory also includes model weights, input/output buffers, CUDA Graphs, and workspace.

Inference efficiency

All results below use one Hopper 80GB GPU, BF16 weights and KV, ordinary autoregressive decoding, and GPU-resident state. EdgeRock-4B and Qwen3.5-4B use FP32 GDN recurrence. EdgeRock combines CUDA Graphs with fused BF16 operations; shared storage for original and packed projections removes 4.95 GiB of duplicate weights and enables batch size 512 at unchanged history capacity.

Single-request decoding and serving throughput

Long-context inference: single-request decoding and best-batch output-token throughput

Single request: 128K input + 128K output, batch size = 1. Decode rate excludes prefill and measures subsequent output tokens after the first token, including sampling and state updates. EdgeRock-4B sustains 233.7 tokens/s, 1.54× Qwen3.5-4B's rate.

Measured GPU allocation includes model weights, history, input/output buffers, and execution workspace. A single 128K-input/128K-output request peaks at 16.02 GiB; the batch-size-512 long-generation sweep peaks at 73.26 GiB. The figure shows concurrency scaling at 4K input + 2K output and allocation across 4K–32K input with 32K output.

Runtime protocol. 1K = 1,024 tokens. EdgeRock configurations use three independent runs; per-workload values are medians, and weighted batch rates pool the 16 length pairs and three repetitions. Timing excludes loading, warmup, tokenization, and text decoding. Workloads use synthetic tokens, a separate 256-token warmup, EOS disabled, temperature 1.0, top-k 20, top-p 0.95, and presence penalty 1.5. In the batch grid, eight continuations share each prompt and retain independent histories. Batch size denotes submitted requests; EdgeRock maintains target concurrency, while vLLM schedules within its cache budget.

Capability evaluation protocol

Most tasks report accuracy; DROP uses F1 in the 29-benchmark mean. The aggregate weights benchmarks equally after each benchmark’s required subject or subtask aggregation. AIME pools retained responses within each edition and weights the three editions equally. Repetition counts vary by model and benchmark.

EdgeRock text evaluation uses temperature 0.6, top-p 0.95, top-k 20, presence penalty 0, seed 20260923, and a 131,072-token response cap. It uses 64 independent responses per item for benchmarks with fewer than 100 questions, 16 for 100–10,000 questions, and one above 10,000. Visual and memory evaluations use the reference arithmetic path. See Appendix A of the report for verification and scoring details.

Frequently asked questions

What stays constant as context grows?

EdgeRock-4B's persistent history per sequence stays constant: recurrent state, the 1,024-position local window, the 1,024-record anchor bank per KV group, and pending candidates all have fixed capacity. Attention KV occupies 72 MiB per sequence; total persistent history occupies 121.76 MiB with FP32 recurrence and auxiliary state. Model weights and execution buffers are accounted for separately in the memory breakdown above.

How do Rock Memory Anchors preserve distant information?

Rock Memory Anchors retain selected information as individually retrievable key–value records after the source tokens leave local attention. A learned writer creates records, admission selects records for the fixed-capacity bank, and later queries retrieve them. Reads use the committed bank; updates take effect at the next block. EdgeRock-4B achieves 94.1% query accuracy in the distant-memory evaluation.

How does EdgeRock-4B compare with other reasoning models?

EdgeRock-4B reaches 82.9% mean pass@1 on AIME 2024–2026, compared with 18.8% for the strongest evaluated bounded-state baseline. Relative to its Qwen3.5-4B backbone, EdgeRock-4B retains 96.3% of the AIME mean while making persistent history constant. Comparisons with MiniCPM5-2B, LFM2.5-2.6B, and other compact models show capability across mathematics, knowledge, coding, and instruction following. The tables above present these three comparison groups separately.
