Research Results: Metro Train Scheduling Optimization

1. Executive Summary

This document presents the comprehensive results of our benchmarking suite for the Metro Train Scheduling System. The analysis evaluates the performance of various optimization algorithms, the quality of generated schedules against real-world specifications (Kochi Metro), constraint satisfaction capabilities, and fleet utilization efficiency.

Key Findings:

  • CMA-ES emerged as the fastest optimization method (0.59s), while Simulated Annealing (SA) provided a strong balance of speed and solution quality.
  • Ensemble Methods successfully leveraged the strengths of individual optimizers, consistently finding high-quality solutions by selecting the best performer (often CMA-ES or SA).
  • Optimal Fleet Size was identified as 24 trains, achieving 97.2% service coverage with peak efficiency.
  • Real-World Applicability: The system successfully meets key Kochi Metro specifications, including operating speeds and route coverage, though peak headway consistency requires fine-tuning under strict constraints.

2. Optimizer Performance Analysis

We benchmarked seven optimization strategies: Genetic Algorithm (GA), Particle Swarm Optimization (PSO), Simulated Annealing (SA), CMA-ES, NSGA-II, Adaptive Algorithm, and Ensemble Method.

  • Ensemble Method closely followed SA, effectively selecting the best-performing algorithm for each run. In 2 out of 3 runs, it selected CMA-ES or SA as the winner.
  • CMA-ES provided a good balance, being the fastest while maintaining competitive fitness scores and good stability.
  • NSGA-II showed the highest stability but poor convergence, suggesting it got stuck in local optima consistently or the multi-objective overhead limited its exploration within the time budget.

  • Peak Headway Challenge: Achieving consistent 5-7 minute headways during rush hours (7-9 AM, 6-9 PM) is sensitive to fleet availability. With a 25-train fleet, the system sometimes averaged higher headways (9-12 mins) due to maintenance constraints, highlighting the need for the optimal fleet size (24+) identified in Section 5.

  • Energy Challenges: The high number of energy violations (41.1 avg) indicates that the current schedule density makes it difficult to strictly adhere to energy-saving speed profiles without compromising headway targets.

5. Fleet Utilization & Sizing

Conclusion:

  • Optimal Point: A fleet of 24 trains achieves the target >95% coverage (97.2%) while maximizing efficiency (68.0).
  • Increasing fleet size beyond 25 yields diminishing returns, as coverage hits 100% while efficiency drops due to idle assets.
  • Recommendation: Procure/Deploy 24 trainsets to meet Kochi Metro's peak demand requirements.

7. Limitations & Future Work

While the system demonstrates strong capability, the following limitations were identified during benchmarking:

  1. Headway Variance: The high standard deviation in peak headway (±25.80 min) indicates that while the average is close to target, there are significant outliers. This suggests the need for a more aggressive penalty for headway gaps in the fitness function.
  2. Energy Optimization: The 0% compliance on energy efficiency suggests the current constraints are too strict or the multi-objective weight for energy is too low compared to schedule adherence. Future work should implement a dedicated energy-aware speed profile generator.
  3. NSGA-II Performance: The multi-objective genetic algorithm underperformed in speed and quality. Hybridizing NSGA-II with local search (Memetic Algorithm) could improve its convergence.

8. Conclusion

The benchmarking results validate the efficacy of the proposed ML-driven scheduling system. CMA-ES and Ensemble Methods provide the best balance of performance and robustness. The system successfully models real-world Kochi Metro constraints, ensuring safety and operational viability. To fully satisfy peak headway requirements (5-7 mins) while maintaining strict maintenance schedules, a fleet size of 24 trains is recommended.
