1. Project Overview & Core Research Question
Q-TensorFormer is an experimental PyTorch and Hugging Face research architecture that investigates closed-loop, information-value-driven resource allocation for Transformer inference under explicit memory, latency, bandwidth, and quality constraints.
Central Research Question
Can a Transformer dynamically allocate computational resources—Tensor-Train rank, layer depth, attention pathway, and KV-cache precision/retention—according to their marginal informational value rather than applying a static computational strategy to every token?
Rather than claiming that dynamic tensor networks automatically accelerate every workload on every processor, Q-TensorFormer is built as a reproducible experimental testbed to measure and determine which benefits are real, under which hardware conditions, and at what runtime cost.
2. Layman's Explanation: How Q-TensorFormer Works End-to-End
Imagine how a human reads a book:
- Standard Dense Transformers read every word with maximum effort: Whether the next word is an obvious filler word ("the", "and") or a complex medical diagnosis, a standard LLM multiplies every token through 100% of its giant weight matrices and stores every past token in full high-precision memory.
- Q-TensorFormer acts like an adaptive reader with a strict budget:
- Step 1 — Sense Token Complexity & Device Pressure (
Information State): As each token enters a layer, a lightweight probe measures how uncertain or ambiguous the token is alongside how full the device's memory and latency budgets are. - Step 2 — Estimate Marginal Value (
Resource Allocator): A controller estimates whether spending extra matrix rank or memory precision on this token will meaningfully improve prediction quality relative to its cost. - Step 3 — Slice Nested Tensor Cores (
Zero-SVD TT-FFN): Instead of storing one monolithic weight matrix, Q-TensorFormer stores weights as a chain of compact Tensor-Train (TT) cores. For easy tokens or tight memory budgets, it slices only the leading rank channels ($r \in {1, 2, 4, 8, 16}$) on the fly without running an expensive Singular Value Decomposition (SVD). - Step 4 — Protect Key Context & Compress Old Memory (
Adaptive KV Cache): It keeps the first 4 "anchor" tokens (Attention Sinks) and the most informative recent tokens while compressing older KV states into 8-bit (INT8) or packed 4-bit (INT4) integers. - Step 5 — Regulate Stability (
PID + Hysteresis): A Proportional-Integral-Derivative (PID) loop adjusts resource shadow prices to track target budgets, while a hysteresis deadband ($\tau = 0.15$) prevents rapid rank oscillation ("chattering") between consecutive tokens.
- Step 1 — Sense Token Complexity & Device Pressure (
3. Edge AI & Cold-Start Motivation
Deploying language and multimodal models on edge hardware—point-of-care medical devices, mobile phones, autonomous drones, robotics controllers, and embedded computers—faces two distinct bottlenecks:
- Cold-Start & Model-Loading Latency:
- Developer Motivation: This research direction was directly motivated by the repository author's practical experience when deploying a 1.5B-parameter medical model (MedGemma 1.5B) on a VRAM-constrained system, where staging and loading the model into memory required approximately 200 seconds before the first token could be generated. (Note: This ~200s observation is cited strictly as the author's motivating developer experience, not as a benchmark executed inside this repository.)
- When a model checkpoint exceeds available fast RAM/VRAM, disk I/O and PCIe paging dominate Time-To-First-Token (
TTFT). Reducing static checkpoint byte volume via Tensor-Train factorization and FP16/INT8 serialization directly shrinks the payload that must be read from flash storage.
- Long-Context KV-Cache Memory Growth:
- During autoregressive decoding, the Key-Value (KV) cache grows linearly with sequence length $L$ and can exhaust edge DRAM even when static weights fit. Combining attention-sink protection with INT8/INT4 quantization and utility-guided eviction bounds peak KV memory to a fixed byte ceiling.

15. Controller Stability, Hysteresis & Ablation Summary
Source: results/raw/controller_audit.json & reports/BENCHMARK_RESULTS.md.
- Hysteresis Anti-Chattering (
MEASUREDover 64 oscillating token steps):- Without hysteresis ($\tau = 0.00$),
InformationValueAllocatorswitches TT rank on25.40%of token steps (mean_rank = 3.484). - With hysteresis ($\tau = 0.15$), rank-switching churn drops to
0.00%(mean_rank = 4.000), compared to11.11%for a simple entropy threshold and63.49%for random rank selection.
- Without hysteresis ($\tau = 0.00$),
- 8D Information State LOFO Ablation (
MEASURED):- Zeroing each individual feature in $z_t$ via
set_ablation(feature, False)confirmed non-zero L2 sensitivity across all 8 signals, led byuncertainty($U_t$, L2 impact4.3095),predictive_entropy($H_t$,3.5497), and hardware pressure signals ($L_t, M_t, B_t$,1.8681each).

- Status: No physical QPU was used (
real_qpu_hardware_executed: false) andpennylaneis optional (not installed in the default CPU environment). Even withClassicalSurrogateUnitary, forcing QKSAM on adds+6.75%CPU latency overhead. Consequently, edge presets (QTF_EDGE,QTF_CLASSICAL_ONLY) disable quantum execution by default.
17. Honest Latency, Memory & Energy Interpretation
Detailed analysis: reports/EDGE_INFERENCE_EVALUATION.md and reports/ENERGY_MEASUREMENT_METHODOLOGY.md.
- Parameter & Memory Compression vs CPU Wall-Clock Speed (
MEASURED):TTLinearachieves massive parameter compression (3.95xat $r=16$ up to56.96xat $r=1$) and reduces active latency by69.1%when slicing from $r=16$ (13.49 ms) down to $r=2$ (4.17 ms).- However, on a CPU where dense weights already fit in cache, a single MKL/BLAS
nn.Linear(512, 2048)call (0.20 msdecode,3.59 msprefill) is faster in wall-clock time than 4 sequentialeinsum/bmmcore contractions. - When TT Compression Wins: TT compression improves deployment latency when (a) a dense model exceeds edge SRAM/VRAM and incurs disk/PCIe paging stalls during cold start or decoding, or (b) fused GPU kernels eliminate intermediate core materialization.
- Energy Measurement Honesty (
ESTIMATEDvsUNVERIFIED):- Because this CPU host lacks hardware power sensors (
NVML/ privilegedRAPL/ inline wattmeter), direct sensor energy (LEVEL 4) is markedUNVERIFIED / N/A. - All energy metrics in
src/hardware_cost_model.py(LEVEL 1analytical,LEVEL 2memory-traffic, andLEVEL 3measured runtime $\times$ nominal TDP) are strictly labeledESTIMATED.

18. Related Work & Novelty Positioning
Full literature review: reports/RELATED_WORK_AND_NOVELTY.md.
Q-TensorFormer builds upon established prior work without claiming priority over individual primitives:
What Q-TensorFormer Contributes: An integrated open-source architecture and benchmark suite that couples an 8D token/hardware state vector ($z_t$), zero-SVD nested TT rank slicing, sink-preserving multi-precision KV caching, and hysteresis-stabilized PID control into a single closed-loop inference framework.
19. Known Limitations & Failure Modes
Full list: reports/KNOWN_LIMITATIONS.md.
- Unfused CPU Contraction Latency: Multi-core
einsumcontraction on CPU has higher wall-clock latency than dense MKL GEMM for small/medium matrices that fit in cache. - CPU
float16Emulation Penalty: Whilefloat16checkpoints cut disk size by49.3%, runningfloat16einsumcontractions on x86 CPUs without native FP16 tensor cores incurs software emulation overhead (TTFT = 335.66 msvs25.82 msinfloat32). - Legacy Checkpoint Incompatibility (
qtensorformer_small.pt): Cannot be loaded withstrict=True(0/113key overlap) because it was exported from an external TensorLy container. It is preserved for provenance. - Canonical Trained Checkpoint Scope: The verified trained canonical checkpoint (
checkpoints/qtensorformer_canonical_trained.ptandcheckpoints/hf_canonical_trained/) was trained on a compact technical educational corpus (data/qtensorformer_corpus.txt), reducing perplexity by 87.2% (from 352.35 to 45.09). Scale pretraining is recommended for open-domain generation. - Hardware Blockers on Current Host: CUDA/Triton GPU execution, PennyLane statevector simulation, and
LEVEL 4hardware power sensor readings areBLOCKED / UNVERIFIEDon the current CPU-only test environment.
